I am having this weird thing with cloth modifier. It appears that there are a couple of things going wrong when I apply the modifier to a plane. First, it doesn't seem to stop easily, meaning it will continue till either the whole thing has almost collapsed onto itself or has crumbled way too much. Secondly, it seems to start the modification while still in air. So, in essence, let's say I have a bowl, on top of which I am dropping a cloth(plane), It will start taking the shape of that bowl while it is, let's say 20 mm above the bowl. What I am missing here?

Hi, nothing is wrong; the first issue is due to the cloth settings, especially (but not only) Stiffness and Damping and also the settings of the Collision Object.
In general: physics simulations are hard (in the beginning) because there are many values to tweak and they are all interrelated and usually, small changes have great effects.
The second thing sounds like completely normal behaviour, because where the bowl (or any object) is, the air under the cloth will be compressed more than where there is 'nothing', if that makes sense..
Making the cloth heavier, or the Air Viscosity lower should reduce that effect.
Although often at a first try, a physics simulation appears to behave unnatural, it is mostly physically correct but the settings are not for the situation you are trying to simulate...
